$R^3$: Training Robots to Reason in Natural Language via Reinforcement Learning

Lehong Wu, Yuxiao Qu, Zheyuan Hu, Ivan Zhang, Limin Wei

his paper introduces $R^3$, a method to train Vision-Language Models (VLMs) to reason in natural language for robotic manipulation. $R^3$ first fine-tunes a VLM on expert reasoning traces and then uses reinforcement learning with offline action data to improve its reasoning capabilities for guiding low-level robotic policies. The core contribution is enabling VLMs to perform free-form language reasoning for complex robotic tasks, unlike prior methods relying on structured supervision.

Two-stage training of ℛ 3 \( \mathcal{R}^{3} \) . ℛ 3 \( \mathcal{R}^{3} \) trains a high-level VLM to reason in natural language and steer a fixed low-level robot policy for robotic manipulation tasks. ℛ 3 \( \mathcal{R}^{3} \) proceeds in two stages: Stage I (mid-training) imbues an off-the-shelf VLM with the reasoning style and behaviors needed to produce useful instructions for the low-level policy. Stage II (single-step RL) further improves the VLM by training it to generate reasoning traces that match the expert instruction in offline data.

AsymSpec speculation step. (a) Drafting & verification: drafter S S reads x full x_{\( \text{full} \)} (logits a a , drafts d 1 : K d_{1:K} ) and x comp x_{\( \text{comp} \)} (logits b b ); verifier L L reads x comp x_{\( \text{comp} \)} (logits t t ). (b) CDA gate & \( \delta \) -fusion: γ eff ( i ) \( \gamma \)_{\( \text{eff} \)}(i) relaxes as full-vs-compressed divergence grows; accepted drafts are committed, otherwise the \( \delta \) -fused arg ⁡ max \( \arg \)\( \max \) is emitted. Only S S consumes x full x_{\( \text{full} \)} .
